The end-to-end architectural design for the machine learning training pipeline begins at the Vehicle, where telemetry and sensor data are collected and routed into the Data Ingestion system. This ingested data is stored centrally in a Data Lake and subsequently processed into Feature Starts for model preparation. A Training Orchestration engine then manages the execution of complex training workloads across distributed GPU Clusters. Once the training phase is finished, the candidate model is cataloged in the Model Registry and passed through a dedicated Validation Pipeline to ensure performance and safety standards are met. After passing all tests, the final model proceeds to Model Saving, where the compiled artifacts are stored and ultimately deployed back to the Vehicle Edge for local, low-latency inference.

2. Component Breakdown & Data Flow

Data Capture (Vehicle)

  • Source Data: Cameras, LiDAR, Radar, CAN Bus signals, GPS, driver actions, disengagement logs.
  • Local Processing: Critical event tagging (e.g., hard braking, manual takeover) saved locally for priority offloading.

Data Ingestion

  • Streaming Ingestion: Real-time metrics/telemetry ingested via Apache Kafka or AWS Kinesis over cellular networks.
  • Batch Ingestion: High-bandwidth multi-camera/LiDAR raw files offloaded via depot Wi-Fi or physical storage swap drives.
  • ETL Pipeline: Data cleansing, temporal synchronization across sensor streams, privacy scrubbing (face and license plate blurring).

Data Lake

  • Storage Tier: Distributed Object Storage (e.g., AWS S3, Azure Blob) organized using Delta Lake or Apache Iceberg.
  • Categorization: Divided into raw land zone, sanitized zone, and annotated dataset zone.

Feature Store

  • Offline Store: Big Data processing (Apache Spark, Ray) generating historical feature tables used for batch training.
  • Point-in-Time Correctness: Ensures no data leakage between past training states and future data.
  • Metadata Registry: Central catalog for feature discovery, definitions, and data lineage (e.g., Feast, Hopsworks).

Training Orchestration

  • Workflow Engine: Manages DAG execution (Kubeflow Pipelines, Airflow).
  • Experiment Management: Tracking parameters, code versions, data snapshots, and run outputs (MLflow, Weights & Biases).
  • Hyperparameter Optimization (HPO): Automated tuning engines (Optuna, Ray Tune).

GPU Clusters

  • Compute Fleet: Distributed Kubernetes cluster (EKS/GKE) provisioned with high-performance GPUs (NVIDIA A100/H100).
  • Distributed Training: Frameworks leveraging PyTorch Distributed Data Parallel (DDP), DeepSpeed, or Megatron-LM.
  • Checkpointing: State saving to object storage to recover from spot instance preemptions or failures.

Model Registry

  • Artifact Versioning: Central repository storing trained model weights, architectures, and build metadata.
  • Lifecycle Management: Staging states (Development, Staged, Production, Archived).

Validation Pipeline

  • Benchmark Datasets: Automated testing against regression, safety-critical edge cases, and difficult weather scenarios.
  • Shadow Testing Engine: Replaying historical driving logs through the new model to compare outputs against ground truth and legacy models.
  • KPI Checks: Evaluating loss metrics, inference latency, memory footprint, and safety thresholds.

Model Saving & Optimization

  • Model Compilation: Target-specific compilation (NVIDIA TensorRT, ONNX Runtime).
  • Optimization Techniques: Quantization (FP32 to INT8/FP16), network pruning, and knowledge distillation.
  • Artifact Package: Containerizing or bundling model files with signature keys for verified execution.

Vehicle Edge

  • Over-The-Air (OTA) Updates: Secure, staged deployment system pushing update packages to vehicle fleets.
  • Edge Hardware: On-vehicle compute units (e.g., NVIDIA DRIVE Orin, custom ASICs).
  • Runtime Execution: Low-latency execution engine running inference on local sensor streams with fallbacks to safe states.

3. Functional Requirements

Data Management & Processing

  • Multi-Modal Ingestion: Ingest and align synchronized camera, LiDAR, and telemetry streams.
  • Dataset Versioning: Immutable snapshotting of datasets tied directly to specific training runs.
  • Automated Annotation: Pipeline support for automated pre-labeling and human-in-the-loop validation tasks.

Training & Orchestration

  • Trigger-Based Runs: Capability to initiate training pipelines on schedules, new data thresholds, or performance drops.
  • Distributed Execution: Automated multi-node, multi-GPU scaling for large-scale vision and perception models.
  • Failure Recovery: Seamless resumption of training from the latest checkpoint upon hardware failure.

Model Governance & Deployment

  • Full Lineage Tracking: Ability to trace any deployed edge model back to its raw training data, code commit, and hyperparameters.
  • Automated Gatekeeping: Block deployment automatically if model fails safety, accuracy, or latency benchmarks.
  • Differential OTA Updates: Support delta updates to minimize bandwidth when pushing new model weights to vehicles.

4. Non-Functional Requirements

Performance & Scalability

  • Ingestion Scale: Support petabytes of sensor data offloaded daily across thousands of active vehicles.
  • Training Scalability: Linear scale-out efficiency up to hundreds of GPU nodes.
  • Edge Inference Latency: Hard real-time constraints on the vehicle (e.g., perception inference completed in <30\text{ms}).

Reliability & Fault Tolerance

  • System Availability: Core pipelines designed for 99.9\% uptime to ensure continuous model iteration.
  • Safe OTA Rollbacks: Automatic rollback to a stable onboard model version if an OTA installation fails or encounters post-update errors.

Security & Compliance

  • Data Privacy: Compliance with regional regulations (e.g., GDPR) requiring automatic blurring of faces/license plates prior to storage.
  • End-to-End Encryption: Encryption of data at rest (AES-256) and in transit (TLS 1.3) from the vehicle to the cloud.
  • Model Signing: Cryptographic signing of model packages to prevent unauthorized code execution on the vehicle edge hardware.

Cost Optimization

  • Tiered Storage Strategy: Transition raw data from high-cost hot storage to low-cost cold storage (e.g., Glacier) based on access patterns.
  • Compute Efficiency: Use of preemptible/spot GPU instances paired with automated checkpointing for cost-effective model training.
